Inspection on root

The inspection controls evaluate a proposed partition. The fitted tree always selects its best legal positive-gain candidate independently.

Considered feature indices (zero based): [0, 1]. Exact computed-gain ties choose lower feature index, then lower threshold. Training stops at nonpositive gain.

Only partitions meeting minimum leaf count are candidates. All row IDs include bootstrap draw identities where relevant.

Limits: 32 rows, 1–4 kernel features (the sheet uses 2), depth ≤ 5, at most 6 trees or stages. Empty-node impurity/risk is conventionally 0; its prediction and empty normalized evaluation are undefined. The sheet bounds features, targets and queries to −10…10. Edits use the selected replay frame, exit replay and leave saved history unchanged.

Start with the controls. Every branch, score, bootstrap draw and stage output comes from the active numeric state; Reset restores the hand-authored inputs.

Compare the same partition in two units

Select Entropy (bits) in the opening sheet. Keep x1 and threshold 2.5. The parent impurity changes from Gini 0.5 to entropy 1 bit; gain changes from 0.25 to about 0.459148. The IDs and counts do not change. Now move the threshold to 1.5: a one-row pure child is attractive, but five other rows still contribute to the score.

Inspect a descendant node to recompute its local probabilities. Its parent count is that node’s count, not the original six. Pure labels, constant features and empty data are explicit controls. Replay depth 0–3 to see how the selected impurity guides actual recursive choices. Reset, numeric Enter/arrows, query fields and the touch-capable slider share the same state and counts.

Impurity summarizes the label distribution

For binary labels in nonempty node S, p0=n0/n and p1=n1/n. Two common impurities are

IG(S)=1−p02−p12=2p0p1,H(S)=−p0log⁡2p0−p1log⁡2p1.I_G(S)=1-p_0^2-p_1^2=2p_0p_1,\qquad H(S)=-p_0\log_2p_0-p_1\log_2p_1.

Gini is zero for pure labels and reaches 1/2 at equal counts. It is the probability of a mismatch between two independently drawn labels from this empirical distribution. Entropy is expected self-information in bits; it is zero when the label is certain and reaches 1 bit at equal binary proportions.

The limit of p log p as p approaches zero is zero. We implement that convention by skipping zero counts, not by evaluating log(0) and multiplying infinity by zero. Empty data do not define probabilities; our zero empty-node impurity is a bookkeeping convention, while the prediction remains undefined.

Derive the weighted gain

Draw a row uniformly from the current node. It lands in the left child with probability nL/n and in the right with probability nR/n. Expected remaining impurity is therefore

Ichild=nLnIL+nRnIR,Δ=IP−Ichild.I_{\mathrm{child}}=\frac{n_L}{n}I_L+\frac{n_R}{n}I_R,\qquad \Delta=I_P-I_{\mathrm{child}}.

For entropy, this reduction is empirical information gain between the branch outcome and label. For Gini, it is a decrease in a different impurity. Both choose locally more homogeneous children; their numeric gains use different scales and must not be compared as though they were the same unit.

A useful Gini identity follows by letting a and b be child positive-label fractions and q=nL/n:

ΔG=2q(1−q)(a−b)2.\Delta_G=2q(1-q)(a-b)^2.

It is nonnegative in exact arithmetic for a legal partition. The identity shows why a large difference between child fractions matters, but also why a tiny child receives a small weight. The runtime uses explicit child risks, while the oracle independently evaluates exact count fractions.

Work the canonical root in bits

Counts [3,3] give parent H=1. At x1 ≤ 2.5, left counts [2,0] give H=0; right counts [1,3] give

HR=−14log⁡214−34log⁡234≈0.811278124459.H_R=-\frac14\log_2\frac14-\frac34\log_2\frac34 \approx0.811278124459.

The weighted child entropy is (2/6)0+(4/6)HR ≈ 0.540852082973. Gain is about 0.459147917027 bits.

At x1 ≤ 1.5, the left has one class-zero row and the right counts [2,3]. Right entropy is about 0.970950594455. Its weight is 5/6, yielding weighted entropy about 0.809125495379 and gain about 0.190874504621. Taking an unweighted average would assign the pure one-row child half the influence and overstate this split’s benefit.

PartitionChild sizesWeighted entropyGain
x1 ≤ 1.51 and 5≈ 0.809125≈ 0.190875
x1 ≤ 2.52 and 4≈ 0.540852≈ 0.459148

Examine common confusions

Information gain is a training split score, not classification accuracy, a coefficient gradient, or a promise of causal information. At a leaf, this sheet predicts the majority label with class-zero ties. Changing the impurity can change the tree without changing that terminal decision policy.

A feature with many possible values offers more opportunities to find a favorable training split. Greedy gain alone does not correct selection bias or protect a held-out population. We support finite numeric features and two labels; missing values, categorical grouping and multiway branching require additional policies.

Connections and checkpoints

Book II’s entropy supplies the uncertainty measure; III-20 supplies the partition search. III-22 replaces class uncertainty with squared error, and III-24 limits which features participate in each node’s search. You should be able to compute both impurities, apply the zero-probability convention, derive the child weights, and distinguish an impurity objective from downstream prediction error.

The actual Python functions stats and evaluate_split produce the active node counts and scores. An exhaustive subset oracle verifies legal splits independently; Fraction checks Gini and Decimal checks entropy. The plot’s color and shape labels show classes, while the numeric table remains authoritative when observations overlap.

Execute the actual Python and NumPy

The imported file below is the canonical runnable source used by the numerical tests. Read the named functions for this chapter; the same recursive kernel supports the Part’s later ensembles. From the book root:

.venv/bin/python -B code/python/p04/trees_ensembles.py

That default command prints the six-row squared-error boosting demonstration as JSON. To run this chapter’s tree or sampling operation, pass a JSON request on stdin with operation equal to tree, bootstrap, bagging or boosting, the displayed rows, and the options keys in DEFAULT_OPTIONS. The independent fixture file contains complete runnable requests for all six lessons. Core lessons require no network or model service.

For this chapter’s exact committed example, run the independent fixture request through the actual canonical module:
